I'm new to tea myself but enjoying it. It helps if you have amazon prime for the little things, you'll find tea turning into more of a hobby than a caffeine fix.

If you don't mind spending maybe $20 on some samplers (to figure out your tastes) and another $20 on a tea set you can easily jump right into it.

Here's a nice little starter tea pot but you'll have to buy a infuser too, but there are other ones that have that built in if you shop around. Here's the one I use it has a filter at the bottom, you simply just place it ontop of your tea cup once the leaves have seeped and then the tea comes shooting into the cup. It's not as pretty but it gets the job done, as well as the option to add on a starter pack for $5 (you get a generous months worth of tea).

Design a Tea (sampler) for $5 pretty interesting, you can pick your prefered kind of tea and then what flavors you want. Just looking at the flavors is enough to make you want to boil some water and get the tea cups ready, really good for realizing what you can make with tea.
